Abstract:

Rule-based methods have been found quite effective in many medical applications due to their better interpretability and greater power in data processing and analysis. Most methods for rule discovery were developed based on the rule generation and rule pruning steps. However, existing rule discovery methods focused on pruning out the redundant and irrelevant rules and didn’t specifically consider the optimal selection of features for rule construction. Identifying the optimal set of features for rule construction is critical for better explaining, cost saving and medical decision making. Thus, we developed a novel framework for building a rule-based sparse model by optimizing the number of features those generate rules and identifying most “informative” rules from complex dataset by group level sparsity (feature → rule). This framework set up a rule-based sparse model with better prediction accuracy, enhanced interpretation and cost saving (less features) by integrating random forest, sparse learning, feature selection and mathematical programming. The proposed rule-based sparse model was demonstrated on a real-world dataset of diabetes and its effectiveness and superiority over thestate-of-the-art methods were thoroughly evaluated by classification accuracy, survival analysis and cost analysis.
